Does Less Hallucination Mean Less Creativity? An Empirical Investigation in LLMs

This analysis delves into the nuanced relationship between hallucination reduction techniques and the creative output of Large Language Models (LLMs). We examine how methods like CoVe, DoLa, and RAG differentially influence convergent and divergent creativity across various LLM families and scales, providing critical insights for AI-driven scientific discovery.

The Creativity-Hallucination Paradox

LLMs excel in language tasks but struggle with factual accuracy (hallucination). While efforts to reduce hallucination are common, their impact on creative generation, especially for scientific discovery, is less understood. Creativity involves unconventional connections, which might be mistaken for hallucination. This study explores this trade-off.

Convergent vs. Divergent Thinking

Drawing from human psychology, creativity is categorized into two main types: convergent thinking (problem-solving within defined means) and divergent thinking (generating diverse ideas). Our research investigates how hallucination reduction impacts both, particularly divergent thinking, which is crucial for novel hypothesis generation.

Chain of Verification (CoVe) Enhances Divergent Creativity

CoVe, a multi-stage reasoning process, involves drafting, generating verification questions, answering them, and refining the final response. Our findings indicate that CoVe consistently enhances divergent creativity across most models and datasets, suggesting that systematic questioning prompts broader exploration of solution space, leading to more diverse and original ideas. This effect is analogous to human brainstorming techniques that stimulate divergent thinking.

Decoding by Contrasting Layers (DoLa) Suppresses Divergent Creativity

DoLa aims to improve factuality by contrasting predictions from higher layers with those from earlier layers. We found that DoLa consistently reduces divergent creativity. Our hypothesis is that DoLa inadvertently suppresses creativity by contrasting early-layer representations, which our linear probe analysis shows are strongly correlated with creative output. These early layers might encode the exploratory and divergent features crucial for creativity.

Retrieval-Augmented Generation (RAG) Has Minimal Impact

RAG enhances factual accuracy by retrieving external information. Our experiments reveal that RAG has minimal influence on divergent creativity across all models and datasets. This neutral effect likely stems from retrieval quality issues, where retrieved documents may lack specific algorithmic insights or contain redundant/misaligned content, failing to introduce genuinely new or relevant information to boost creativity.

12.5% Highest divergent creativity gain observed with CoVe on LLaMA 1B (NeoCoder dataset).

CoVe's Iterative Verification Process

Draft Initial Answer
Generate Verification Questions
Answer Questions & Synthesize Recommendations
Produce Refined Final Response
Method Impact on Divergent Creativity Mechanism
Chain of Verification (CoVe)
  • Enhances
  • Models generate more diverse ideas
  • Promotes broader solution space exploration
  • Reduces fixation on single paths
Decoding by Contrasting Layers (DoLa)
  • Suppresses
  • Models generate fewer unique ideas
  • Inadvertently contrasts creativity-correlated early layers
  • Removes exploratory features
Retrieval-Augmented Generation (RAG)
  • Minimal/Neutral
  • Slight fluctuations, no consistent trend
  • Dependent on retrieval quality and relevance
  • Irrelevant context can mislead LLM generation

AI in Scientific Hypothesis Generation

In AI-assisted scientific discovery, factual accuracy and creative hypothesis generation are both crucial. Our findings provide guidance for selecting appropriate hallucination-reduction methods. For instance, tasks requiring novel ideation might benefit from CoVe, while tasks demanding strict factual precision without emphasis on novelty might use DoLa with caution.

  • CoVe: Ideal for exploratory research, brainstorming novel theories.
  • DoLa: Suitable for refining known facts, but may limit breakthrough ideas.
  • RAG: Enhances grounding, but its impact on novel creativity is indirect and depends on the novelty of retrieved information.
