Existing explanation methods focus on individuals, not groups, failing to address complex group dynamics and fairness concerns. We propose a systematic framework for generating group counterfactual explanations. This includes defining item-level metrics (recognition, rating, influence) and evaluation dimensions (minimality, interpretability, cost-efficiency, utility, and fairness). A family of heuristic algorithms—ParetoFiltering, FixedWindow, GreedyGrow, Grow&Prune, and ExpRebuild—are introduced to efficiently discover these explanations, balancing quality with computational cost.

Understanding the fundamental building blocks of group counterfactual explanations involves defining user and group interactions, how recommendations are generated, and key item-level metrics. These metrics, such as Item Recognition, Item Rating, and Item Influence on the Target Item, provide a quantitative basis for evaluating an item's contribution to a group recommendation. The aggregated Item Total Score combines these insights to guide the explanation generation process effectively.

The concept of Item Set Explanatory Power is introduced to quantify how likely a set of items, when removed, would cause the target item to disappear from the recommendation list, setting the stage for identifying true counterfactuals.

To address the inherent combinatorial complexity of finding group counterfactual explanations, we introduce a suite of heuristic algorithms. These include ParetoFiltering for initial search space reduction, FixedWindow for local search and refinement, GreedyGrow for progressive explanation building, and its refinements Grow&Prune and ExpRebuild for enhancing minimality and interpretability. Each algorithm offers distinct trade-offs in terms of computational cost, explanation size, and fairness, designed to work within practical budget constraints.

Evaluating the quality of group counterfactual explanations goes beyond simple correctness. We introduce comprehensive metrics covering Minimality (explanation size), Interpretability (item familiarity), Cost-Efficiency (recommender calls), Utility (combined minimality and interpretability), and crucially, Fairness. Fairness ensures that the burden of the explanation (i.e., items removed) is distributed equitably among group members, preventing a single user from being disproportionately affected. These dimensions collectively provide a holistic view of an explanation's effectiveness and ethical implications.

Dataset Specific Performance (MovieLens vs. Amazon)

Our experiments on MovieLens (dense) and Amazon (sparse) datasets reveal how dataset characteristics impact algorithm performance. In MovieLens, most methods perform adequately, with trade-offs primarily in cost and explanation size. Pareto-filtering's benefits are moderate here.

On the other hand, the sparse Amazon dataset presents a significant challenge for methods like FixedWindow, which can become computationally prohibitive. Here, Pareto-filtering demonstrates substantial reductions in explanation costs and sizes, highlighting its critical role in more challenging, real-world scenarios. This underscores the need for adaptive strategies based on dataset density.
