Detection of Illicit Content on Online Marketplaces using Large Language Models

Online marketplaces, while revolutionizing global commerce, have inadvertently facilitated the proliferation of illicit activities, including drug trafficking, counterfeit sales, and cybercrimes. Traditional content moderation methods such as manual reviews and rule-based automated systems struggle with scalability, dynamic obfuscation techniques, and multilingual content. Conventional machine learning models, though effective in simpler contexts, often falter when confronting the semantic complexities and linguistic nuances characteristic of illicit marketplace communications. This research investigates the efficacy of Large Language Models (LLMs), specifically Meta's Llama 3.2 and Google's Gemma 3, in detecting and classifying illicit online marketplace content using the multilingual DUTA10K dataset. Employing fine-tuning techniques such as Parameter-Efficient Fine-Tuning (PEFT) and quantization, these models were systematically benchmarked against a foundational transformer-based model (BERT) and traditional machine learning baselines (Support Vector Machines and Naive Bayes). Experimental results reveal a task-dependent advantage for LLMs. In binary classification (illicit vs. non-illicit), Llama 3.2 demonstrated performance comparable to traditional methods. However, for complex, imbalanced multi-class classification involving 40 specific illicit categories, Llama 3.2 significantly surpassed all baseline models. These findings offer substantial practical implications for enhancing online safety, equipping law enforcement agencies, e-commerce platforms, and cybersecurity specialists with more effective, scalable, and adaptive tools for illicit content detection and moderation.

LLMs Revolutionize Illicit Content Detection

Our analysis demonstrates how Large Language Models (LLMs) like Llama 3.2 and Gemma 3 significantly outperform traditional methods in detecting and classifying illicit content on online marketplaces, especially for complex, multi-class scenarios. This advancement offers critical tools for enhancing online safety and combating cybercrime.

Delves into the models' capacity for more nuanced, fine-grained understanding by categorizing content into 40 specific illicit types. This represents a significantly greater challenge due to increased class granularity, semantic overlap, and dataset imbalance.

LLM vs. Baseline Model Capabilities

Feature Traditional ML (SVM/Naive Bayes) Transformer (BERT) LLMs (Llama/Gemma)
Scalability with Data Struggles with large, unstructured, multilingual data. Better, but fine-tuning can be resource-intensive for complex data. Highly scalable, excelling with complex, multilingual datasets via advanced pre-training.
Semantic Understanding Relies on explicit features; limited semantic depth. Good context awareness and semantic understanding. Superior context and language pattern comprehension, especially for nuanced illicit content.
Adaptability to Obfuscation Requires constant manual feature engineering. Adapts better, but still sensitive to novel obfuscation. Dynamic adaptation via fine-tuning; learns from evolving deceptive language patterns.
Resource Intensity Low computational cost, fast inference. Moderate computational cost, fine-tuning can be demanding. Higher computational cost, but PEFT/quantization significantly optimize resource usage.

Analyzes the practical trade-offs between performance and computational cost, including the efficacy of PEFT and quantization techniques for deploying LLMs in real-world scenarios. We compare resource demands across all model types.

Mitigating Drug Trafficking on Social Media

A major social media platform struggled with the rapid proliferation of drug trafficking content, often disguised with evolving slang and emojis. Traditional rule-based systems and even initial BERT models were overwhelmed, leading to high false negatives. Implementing a fine-tuned Llama 3.2 model, trained on an expanded dataset including obfuscated language, led to a 35% reduction in undetected drug-related posts within three months, significantly improving content moderation accuracy and speed. The LLM's ability to discern subtle contextual cues proved crucial.
