Toward Sustainable Education: Generative AI-Powered Argument Mining in Student Writing

This paper systematically evaluates the effectiveness of leading Large Language Models (LLMs) in identifying argument components and strategies in student essays, revealing significant performance improvements with Chain-of-Thought (CoT) and Multi-Task Learning (MTL) methods. It also employs learning analytics to uncover how argument structure relates to writing quality, demonstrating that high-quality essays feature more complex and diverse argumentation. The findings offer practical implications for AI-driven assessment and personalized instruction in sustainable education, fostering students' argumentative skills and critical thinking.

LLM Performance Across Learning Methods

Method Argument Components (Micro-F1) Argument Strategies (Chunk-F1)
Zero-shot
  • Low baseline performance.
  • Very low baseline performance.
STL (Single-Task Learning)
  • Improved, but sub-optimal.
  • Modest improvement.
CoT (Chain-of-Thought)
  • Significant improvement, especially for reasoning.
  • Optimal performance, mimics human cognition.
MTL (Multi-Task Learning)
  • Optimal performance, effective knowledge transfer.
  • Improved, but CoT is often superior for strategies.

Impact of CoT on Strategy Prediction

31.33%

Highest Chunk-F1 for Argument Strategy Prediction (ChatGLM-9B with CoT)

The Chain-of-Thought (CoT) method significantly enhanced LLM performance in argument strategy prediction, demonstrating its effectiveness in handling complex argumentative reasoning tasks by simulating human cognitive processes. This is exemplified by ChatGLM-9B's superior 31.33% Chunk-F1 score with CoT.

Qwen3-4B Model Improvement Case

A focused analysis of the Qwen3-4B model's performance on the example essay from Figure 3 (Appendix B.2) demonstrates the tangible benefits of CoT and MTL.

Argument Component Detection: STL missed several components like #1 B-Elaboration, #2 I-Elaboration, and #10 B-Major Claim. Both CoT and MTL successfully identified these, with MTL showing the most comprehensive results.

Argument Strategy Prediction: STL completely failed to identify any strategies for the given example. CoT correctly identified ['Background'] for #1, #2 -> #3 and ['Detail'] for #14, #15 -> #13. MTL also identified ['Background'] and ['Progression'] for other relations, demonstrating its broader applicability. Both CoT and MTL significantly outperformed STL.

This case study underscores how CoT and MTL methods can effectively enhance LLM performance in automatic argument structure parsing, validating their practical utility in educational contexts.
