AUTOENCODER-BASED DENOISING DEFENSE AGAINST ADVERSARIAL ATTACKS ON OBJECT DETECTION
Deep learning-based object detection models are vulnerable to adversarial examples. This work proposes an autoencoder-based denoising defense to recover degraded object detection performance. Vulnerability of DL Models

Enterprise Process Flow: Autoencoder Defense
Our method uses a single-layer convolutional autoencoder to remove Perlin noise perturbations from adversarially attacked images before feeding them into a YOLOv5 model for object detection. The autoencoder is trained on clean images and then tested on adversarial ones.
Autoencoder Architecture
The autoencoder features an encoder (3x3 convolutional layer with 32 filters, ReLU activation, and 2x2 MaxPooling) and a decoder (3x3 convolutional layer with 32 filters, ReLU activation, 2x2 UpSampling, and a final 3-filter sigmoid layer). This design compresses and reconstructs images, learning to effectively remove noise.
After applying the autoencoder defense, the overall bbox mAP improved from 0.1640 to 0.1700, representing a 3.7% recovery from the adversarial attack, demonstrating the autoencoder's capability to restore detection performance.
The autoencoder also led to a significant 10.8% improvement in bbox mAP@50 (from 0.2780 to 0.3080), suggesting effective recovery of coarse object localization details.
bbox mAP@75 Limitation
Conversely, bbox mAP@75 slightly decreased from 0.1680 to 0.1600. This indicates that the precise localization required at high IoU thresholds is adversely affected by the loss of fine-grained details during the autoencoder's reconstruction process, highlighting an inherent trade-off between adversarial noise removal and detail preservation when using standard pixel-level losses.
