Enterprise AI Analysis
Fostering human learning is crucial for boosting human-AI synergy
A recent meta-analysis showed human-AI combinations often underperform the best individual agent. This paper argues that this is due to insufficient attention to human learning in experimental designs. Re-analysis of 74 studies revealed that designs fostering learning (e.g., outcome feedback) were rare. Crucially, studies providing outcome feedback, especially when paired with AI explanations, showed positive human-AI synergy, while explanations without feedback were strongly linked to negative synergy. This suggests that current literature underestimates human-AI collaboration potential due to designs that hinder human learning and adaptive collaboration strategies.

Human-AI Synergy
Human-AI synergy occurs when the combined performance of humans and AI surpasses either acting alone. The meta-analysis by Vaccaro et al. [1] initially showed an average negative synergy, meaning human-AI combinations performed worse than the better individual agent. Our re-analysis suggests this view is pessimistic due to experimental designs that don't facilitate human learning.
The Role of Feedback
Outcome feedback, where participants are told the correct response, is crucial for human learning and adapting strategies [6, 5, 7, 8]. The original meta-analysis found most studies (64 out of 74) lacked this feature. Our re-analysis shows that studies providing feedback tend to report higher human-AI synergy. This implies that humans need opportunities to learn and refine their understanding of the task and the AI's reliability.
AI Explanations & Learning
AI explanations can help humans understand how a model arrived at its output, guiding their attention to relevant features [10]. However, our re-analysis revealed a crucial interaction: AI explanations only led to positive synergy when paired with outcome feedback. Without feedback, AI explanations were strongly linked to negative synergy. This suggests that explanations are useful for synergy only when humans can learn to verify the AI's reliability.
Enterprise Process Flow
Without feedback, humans struggle to adapt to AI's strengths and weaknesses, leading to suboptimal collaboration. This highlights a critical oversight in many experimental designs.
Enterprise Process Flow
When humans receive feedback and AI explanations, they can learn to verify AI reliability, adapt their strategies, and achieve superior joint performance. This emphasizes the importance of learning-centric designs.
Our re-analysis shows a clear trend: studies incorporating outcome feedback tend to report higher human-AI synergy. This is a crucial indicator that learning opportunities are a key driver for effective human-AI collaboration.
| Feature | Without Feedback | With Feedback |
|---|---|---|
| Typical Synergy (Hedge's g) | -0.17 | 0.12 |
| AI Explanations + Synergy | Strongly Negative (-0.31) | Positive (0.30) |
This comparison table starkly illustrates the impact of feedback. While AI explanations alone can lead to negative synergy, combining them with feedback transforms the outcome to positive synergy, showcasing the critical role of human learning.
Case Study: Adaptive Reliance in Diagnostic Tasks
Consider a medical diagnostic scenario where an AI provides a diagnosis and an explanation. If a human physician only receives the AI's output and explanation without knowing the correct diagnosis (feedback) over multiple cases, they cannot reliably learn when to trust or override the AI. They might over-rely on the AI even when it's wrong, or under-rely when it's correct but its explanation is unclear. However, if they consistently receive outcome feedback (the actual diagnosis) and the AI's explanations, they can learn to correlate specific AI explanation patterns with correctness, identify the AI's failure modes, and adapt their decision-making to achieve superior diagnostic accuracy compared to either human or AI acting alone. This 'learning to verify' through feedback is essential for fostering true human-AI synergy in high-stakes environments.
