Understanding Traffic Dynamics in Smart Villages

Predicting vehicle traffic optimizes transportation management and urban planning. In this paper, we combine real-time data from vehicle-detection Internet of Things (IoT) devices with external variables from Google Trends. Integrating such heterogeneous, complex data streams is challenging for traditional machine learning models that struggle to capture the dynamics of traffic patterns, which are influenced by multiple interdependent factors.

To effectively model these complex, interdependent factors, we introduce the Granger-Causal Transformer (GCT), a transformer-based architecture for traffic prediction that integrates an LSTM network with a modified multi-head attention mechanism. This mechanism extends Granger causality to the spatio-temporal domain to analyze all causality relations between features consistently, while capturing long-range dependencies and temporal patterns.

GCT Architecture & Feature Selection

The GCT architecture explicitly incorporates Granger causality into the attention mechanism to statistically test and model causal dependencies between pairs of variables. It combines an LSTM layer to capture sequential dependencies with an attention layer integrating a causality mask. This mask accounts for Granger-causal relationships, reflecting both strength and precedence between variables.

Prior to GCT prediction, external variables are validated using a language model aligned with the data's linguistic context. A dual-filtering approach, comprising a Granger causality test and a correlation filter, ensures only causally relevant and highly correlated time series are selected for prediction. This rigorous preprocessing minimizes noise and redundancy, providing a clean and relevant input for the GCT model.

Superior Performance & Robustness

Our evaluation against classical statistical models, deep learning models, large foundation models, and transformers across two case studies demonstrates consistently superior performance and generalizability. GCT achieved R² improvements between 47% and 68% compared to the best performing baselines, alongside substantial reductions in MAE and MSE.

An ablation study confirmed the critical contribution of each causal component: the causality filter, correlation filter, and the causality mask within the transformer. Removing any of these elements led to a significant decline in predictive accuracy, underscoring their synergistic impact on the model's effectiveness.

Validated Across Diverse Environments

The methodology's robustness and generalizability were validated through a second case study in Salt Lake City, USA. Here, GCT again significantly outperformed all other methods, achieving the highest R² score (0.5058) and lowest errors (MAE 0.0501, MSE 0.0037).

This success in both a sparse, rural setting (Alpujarra, Spain) and a dense urban setting (Salt Lake City, USA) highlights the broad applicability and effectiveness of the GCT approach for multivariate traffic analysis, confirming its ability to adapt to diverse contextual and linguistic data environments.
