Machine Unlearning for Robust DNNs: Attribution-Guided Partitioning and Neuron Pruning in Noisy Environments

Deep neural networks, while powerful, are highly vulnerable to noisy or corrupted training data, leading to suboptimal performance and generalization. Traditional noise mitigation strategies are often limited by strong assumptions or high retraining costs. Our framework introduces an innovative machine unlearning approach that uses attribution-guided data partitioning and neuron pruning to efficiently enhance model robustness without explicit noise modeling or full retraining. This allows enterprises to build more reliable AI systems from imperfect real-world data.

Enhanced Robustness in Image Classification

Our framework significantly improves model resilience in computer vision tasks, specifically demonstrated on the CIFAR-10 dataset with label corruption. By leveraging attribution-guided data partitioning, we effectively identify and filter out noisy samples from the training data. The subsequent discriminative neuron pruning targets and removes model components that learned spurious correlations from noise, preserving only valuable generalizable knowledge. This leads to superior accuracy even under high noise conditions, outperforming conventional retraining methods and delivering substantial computational efficiency gains (Tables 1, 3, 4, 5).

Generalizable Efficacy in Speech Command Recognition

The method's generalizability is validated on the Speech Commands dataset for keyword spotting. The framework's ability to discern clean from noisy data and selectively prune noise-sensitive neurons translates to enhanced performance in speech recognition, a domain often susceptible to real-world audio interference. Our approach yielded notable improvements in accuracy and F1-score, along with a high Top-3 prediction reliability of 93.41% (Table 6), confirming its potential for building robust AI systems across diverse modalities.

Real-World Impact: Correcting Misclassifications

As illustrated in Figure 2 and Figure 4 of the original paper, our method successfully rectifies critical misclassifications made by the initial model. For instance, images initially misidentified (e.g., 'ship' as 'frog') are correctly classified after our unlearning and fine-tuning process. Similarly, audio commands like 'go' initially mislabeled as 'no' are accurately recognized. This demonstrates the framework's ability to recover and strengthen genuine discriminative features, even in the presence of strong noise, leading to reliable predictions in real-world scenarios. This capability is crucial for enterprise applications where robust model performance directly impacts operational efficiency and decision-making.
