Software application in early blight detection in tomatoes using modified MobileNet architecture

Revolutionizing Tomato Disease Detection with AI

This study presents an automated framework for early blight detection in tomato plants, using a modified MobileNet architecture. It combines transfer learning, custom convolutional layers, and an ensemble of classifiers, achieving high accuracy (94.5% on independent field data) and efficient on-device performance (23 ms/image, 4.2M parameters). This addresses critical needs in global food security by providing accessible plant disease detection for smallholder farmers.

Enhanced MobileNetV2 with Custom Layers

The core of our innovation lies in a modified MobileNetV2 architecture. We integrated two custom convolutional layers, named Custom_Feature_Extraction_Block1 (3x3 conv, 32 filters) and Custom_Feature_Extraction_Block2 (5x5 conv, 64 filters). These blocks are specifically designed to capture both fine-grained textures and larger lesion patterns characteristic of early blight, which are often missed by generic feature extractors. L2 regularization, batch normalization, and dropout mechanisms are also incorporated to mitigate overfitting and enhance generalization. This results in a lightweight model (4.2M parameters) optimized for on-device efficiency without sacrificing detection accuracy.

Robust Performance Across Diverse Conditions

Our framework demonstrates exceptional performance, achieving 100% accuracy on a controlled validation subset of the PlantVillage dataset. More critically, it maintained 94.5% accuracy on an independent dataset (tomato_dataset_v2, 30,609 images across 10 classes) containing field-acquired images with natural noise and variable illumination. This robust generalization capability, confirmed on unseen, diverse data, is a key differentiator. The meta-learned ensemble strategy, dynamically weighting Random Forest, SVM, and Gradient Boosting classifiers based on F1-score, further safeguards prediction accuracy, contributing an additional 2.1 points to the F1-score over the custom layer improvements.

Actionable Insights & On-Device Readiness

To foster trust and practical utility, we integrated Explainable AI (XAI) techniques. SHapley Additive exPlanations (SHAP) identify global feature importance (e.g., specific lesion patterns), while Gradient-weighted Class Activation Mapping (Grad-CAM) visualizes the exact pixel regions influencing the model's decision on individual leaf images. This allows farmers to visually confirm the model's reasoning. The model's lightweight design (23 ms/image inference on Raspberry Pi 4) makes it ideal for mobile applications, offline farm advisory tools, and low-cost drones for aerial crop monitoring, addressing critical needs in resource-constrained agricultural environments.

Case Study: Empowering Smallholder Farmers

Imagine a smallholder tomato farmer in a rural community, traditionally relying on manual inspection for disease detection. Early blight is a constant threat, often leading to significant yield losses. With our lightweight, AI-powered system, the farmer can now use a smartphone or an inexpensive drone to capture images of their tomato plants. The application, running on-device without internet access, instantly identifies early blight with 94.5% field accuracy, providing immediate, actionable insights.

This early detection enables targeted treatment, drastically reducing pesticide use and preventing widespread crop damage. For this farmer, it means saving up to 30% of their annual yield, translating into an estimated $5,000 increase in annual income and greater food security for their family and community. The transparency offered by Grad-CAM builds trust, as the farmer can visually confirm the disease regions highlighted by the AI.
