WEIGHT SPACE REPRESENTATION LEARNING WITH NEURAL FIELDS
In this work, we investigate the potential of weights to serve as effective representations, focusing on neural fields. Our key insight is that constraining the optimization space through a pre-trained base model and low-rank adaptation (LoRA) can induce structure in weight space. Across reconstruction, generation, and analysis tasks on 2D and 3D data, we find that multiplicative LoRA weights achieve high representation quality while exhibiting distinctiveness and semantic structure. When used with latent diffusion models, multiplicative LoRA weights enable higher-quality generation than existing weight-space methods.

Pioneering Multiplicative LoRA for Neural Fields
Our methodology introduces multiplicative LoRA (mLoRA) within a pre-trained base neural field to create structured weight space representations. Unlike standard additive LoRA, mLoRA applies weight updates through element-wise multiplication, which naturally aligns with modulation mechanisms in generative neural fields. This design is crucial for obtaining good weight space structure. We also address permutation symmetry using an asymmetric masking technique, especially effective for mLoRA by zeroing out frozen entries to avoid entanglement. For generative tasks, we employ a hierarchical diffusion transformer that respects the structural properties of low-rank weight matrices, modeling both intra-layer dependencies and cross-layer relationships.
Unlocking High-Fidelity Reconstruction & Generation
In reconstruction tasks, mLoRA-Asym achieves superior quality (e.g., 36.91 PSNR for 2D FFHQ) with compact parameter counts, benefiting from the base network's inductive bias. This outperforms both standalone MLPs and additive LoRA. For generation, our diffusion models trained on multiplicative LoRA weights enable higher-quality generation than previous weight-space methods. mLORA-Asym consistently shows the best performance across 2D FFHQ and 3D ShapeNet datasets (e.g., 0.073 FD for FFHQ), producing diverse samples with high-frequency details. This success highlights the importance of favorable weight space geometry for effective diffusion-based generation.
Structured Weight Spaces: The Key to Predictable AI
Our analysis reveals that mLoRA-based representations exhibit improved weight similarity and linear mode connectivity compared to standalone MLPs and additive LoRA. While LoRA improves similarity, mLoRA-Asym demonstrates exceptional behavior, maintaining very high similarity and very low linear mode connectivity barriers even with different initializations. This suggests that mLoRA-Asym weights converge to a linear mode, aligning well with base networks once permutation symmetry is eliminated. This structured geometry is critical for effective learning and generative performance, preventing the chaotic parameter configurations seen in less constrained approaches.
Revealing Semantic Structure in Network Weights
For discriminative tasks (classification and clustering), mLoRA representations show a clear progression in semantic structure. mLORA achieves 90.0% accuracy with a linear classifier on the ShapeNet ten-category dataset, outperforming other representations. t-SNE visualizations further confirm that multiplicative LoRA weights, particularly mLoRA-Asym, demonstrate clear class separation, indicating their capability to capture meaningful semantic information. These findings challenge the traditional view of neural network weights as uninterpretable, establishing their viability as robust semantic representations for various analytical tasks.
